Neuro-symbolic AI integrates several technologies to let enterprises efficiently solve complex problems and queries demanding reasoning skills despite having limited data. Now, new training techniques in generative AI (GenAI) models have automated much of the human effort required to build better systems for symbolic AI. The second module uses something called a recurrent neural network, another type of deep net designed to uncover patterns in inputs that come sequentially. (Speech is sequential information, for example, and speech recognition programs like Apple’s Siri use a recurrent network.) In this case, the network takes a question and transforms it into a query in the form of a symbolic program. The output of the recurrent network is also used to decide on which convolutional networks are tasked to look over the image and in what order.
One Google engineer was even fired after publicly declaring the company’s generative AI app, Language Models for Dialog Applications (LaMDA), was sentient. Marcus sticking to his guns is almost reminiscent of how Hinton, Bengio, and LeCun continued to push neural networks forward in the decades where there was no interest in them. Their faith in deep neural networks eventually bore fruit, triggering the deep learning revolution in the early 2010s, and earning them a Turing Award in 2019. But here, I would like to generalization of knowledge, a topic that has been widely discussed in the past few months. While human-level AI is at least decades away, a nearer goal is robust artificial intelligence.

What it’s basically doing is predicting the next word in a sequence based on statistics it has gleaned from millions of text documents. A well-trained neural network might be able to detect the baseball, the bat, and the player in the video at the beginning of this article. But it will be hard-pressed to make sense of the behavior and relation of the different objects in the scene. Neural networks also start to break when they deal with novel situations that are statistically different from their training examples, such as viewing an object from a new angle.

Computers see visual data as patches of pixels, numerical values that represent colors of points on an image. The naïve approach to solving this problem with symbolic AI would be to create a rule-based system that compares the pixel values in an image against a known sequence of pixels for a specific object. The problem with this approach is that the pixel values of an object will be different based on the angle it appears in an image, the lighting conditions, and if it’s partially obscured by another object. Computer programming languages have been created on the basis of symbol manipulation.
But it is evident that without bringing together all the pieces, you won’t be able to create artificial general intelligence. Neural networks have so far proven ChatGPT App to be good at spatial and temporal consistency in data. But they are very poor at generalizing their capabilities and reasoning about the world like humans do.
This fusion gives users a clearer insight into the AI system’s reasoning, building trust and simplifying further system improvements. By combining these approaches, the AI facilitates secondary reasoning, allowing for more nuanced inferences. This secondary reasoning not only leads to superior decision-making but also generates decisions that are understandable and explainable to humans, marking a substantial advancement in the field of artificial intelligence. Another area of innovation will be improving the interpretability and explainability of large language models common in generative AI.

We tuned four language models using our symbol-tuning procedure, utilizing a tuning mixture of 22 datasets and approximately 30K arbitrary symbols as labels. Thinking involves manipulating symbols and reasoning consists of computation according to Thomas Hobbes, the philosophical grandfather of artificial intelligence (AI). Machines have the ability to interpret symbols and find new meaning through their manipulation — a process called symbolic AI. In contrast to machine learning (ML) and some other AI approaches, symbolic AI provides complete transparency by allowing for the creation of clear and explainable rules that guide its reasoning. AI systems often struggle with complex problems in geometry and mathematics due to a lack of reasoning skills and training data. AlphaGeometry’s system combines the predictive power of a neural language model with a rule-bound deduction engine, which work in tandem to find solutions.
There’s no way in these systems to represent what a ball is or what a bottle is and what these things do to one another. So the results look great, but they’re typically not very generalizable. Reinforcement learning, another subset of machine learning, is the type of narrow AI used in many game-playing bots and problems that must be solved through trial-and-error such as robotics. Narrow AI systems are good at performing a single task, or a limited range of tasks. But as soon as they are presented with a situation that falls outside their problem space, they fail.
But distilling human expertise into a set of rules and facts turns out to be very difficult, time-consuming and expensive. This was called the “knowledge acquisition bottleneck.” While simple to program rules for math or logic, the world itself is remarkably ambiguous, and it proved impossible to write rules governing every pattern or define symbols for vague concepts. The answers might change our understanding of how intelligence works and what makes humans unique. These two approaches, responsible for creative thinking and logical reasoning respectively, work together to solve difficult mathematical problems.
Various AI algorithms then return new content in response to the prompt. Content can include essays, solutions to problems, or realistic fakes created from pictures or audio of a person. ML may focus on specific elements of a problem where explainability doesn’t matter, whereas symbolic AI will arrive at decisions using a transparent and readily understandable pathway. The hybrid approach to AI will only become increasingly prevalent as the years go by.
Symbols are also more conducive to formal verification techniques, which are critical for some aspects of safety and ubiquitous in the design of modern microprocessors. To abandon these virtues rather than leveraging them into some sort of hybrid architecture would make little sense. It took until the 2010s for the power of neural networks trained via backpropagation to truly make an impact. Working with a couple of graduate students, Hinton showed that his technique was better than any others at getting a computer to identify objects in images. They also trained a neural network to predict the next letters in a sentence, a precursor to today’s large language models. Hinton is best known for his work on a technique called backpropagation, which he proposed (with a pair of colleagues) in the 1980s.
A full list of actions used for this sampling can be found in Extended Data Table 1. In our work, we sampled nearly 1 billion of such premises in a highly parallelized setting, described in Methods. Note that we do not make use of any existing theorem premises from human-designed problem sets and sampled the eligible constructions uniformly randomly. The future of artificial intelligence is seen as optimistic and multifaceted. It will be characterized by the synergy of various methods and approaches, including those developed decades ago. In a set of often-cited rule-learning experiments conducted in my lab, infants generalized abstract patterns beyond the specific examples on which they had been trained. Subsequent work in human infant’s capacity for implicit logical reasoning only strengthens that case. In particular, we will highlight two applications of the technology for autonomous driving and traffic monitoring. Since then, progress in other neural network techniques and architectures has helped expand generative AI capabilities. Techniques include VAEs, long short-term memory, transformers, diffusion models and neural radiance fields. Consider, for instance, the following set of pictures, which all contain basketballs. It is clear in the images that the pixel values of the basketball are different in each of the photos. In some of them, parts of the ball are shaded with shadows or reflecting bright light. In some pictures, the ball is partly obscured by a player’s hand or the net.
The video previews the sorts of questions that could be asked, and later parts of the video show how one AI converted the questions into machine-understandable form. If you ask it questions for which the knowledge is either missing or erroneous, it fails. In the emulated duckling example, the AI doesn’t know whether a pyramid and cube are similar, because a pyramid doesn’t exist in the knowledge base. To reason effectively, therefore, symbolic AI needs large knowledge bases that have been painstakingly built using human expertise.
AI, as envisioned by McCarthy and his colleagues, is an artificial intelligence system that can learn tasks and solve problems without being explicitly instructed on every single detail. It should be able to do reasoning and abstraction, and easily transfer knowledge from one domain to another. Of course, one can easily imagine an AI system that is pure software intellect, so to speak, so how do LLMs shape up when compared to the mental capabilities listed above?
They can also be used to describe other symbols (a cat with fluffy ears, a red carpet, etc.). In the end, neuro-symbolic AI’s transformative power lies in its ability to blend logic and learning seamlessly. In the medical field, neuro-symbolic AI could combine clinical guidelines with individual patient data to suggest more personalized treatment options. For example, it might consider a patient’s medical history, genetic information, lifestyle and current health status to recommend a treatment plan tailored specifically to that patient. Once they are built, symbolic methods tend to be faster and more efficient than neural techniques. They are also better at explaining and interpreting the AI algorithms responsible for a result.
This problem is not just an issue with GenAI or neural networks, but, more broadly, with all statistical AI techniques. A huge language model might be able to generate a coherent text excerpt or translate a paragraph from French to English. But it does not understand the meaning of the words and sentences it creates.
Generative AI could also play a role in various aspects of data processing, transformation, labeling and vetting as part of augmented analytics workflows. Semantic web applications could use generative AI to automatically map internal taxonomies describing job skills to different taxonomies on skills training and recruitment sites. Similarly, business teams will use these models to transform and label third-party data for more sophisticated risk assessments and opportunity analysis capabilities. What’s important here is the term “open-ended domain.” Open-ended domains can be general-purpose chatbots and AI assistants, roads, homes, factories, stores, and many other settings where AI agents interact and cooperate directly with humans.

A medical diagnosis system can be checked against medical knowledge to provide verification and explanation of the outputs from a machine learning system.
Joseph Weizenbaum created computer program Eliza, capable of engaging in conversations with humans and making them believe the software has human-like emotions. Mechanical engineering graduate student James Adams constructed the Stanford Cart to support his research on the problem of controlling a remote vehicle using video information. Arthur Samuel created the Samuel Checkers-Playing Program, the world’s first self-learning program to play games. The complexity of blending these AI types poses significant challenges, particularly in integration and maintaining oversight over generative processes.
